And I also noticed that the go.mod file is not following Semantic Import Versioning so I cannot use clientv3 with the go.mod file at all.

You need manutually modify the go.mod file.

From google.golang.org/grpc v1.26.1 to google.golang.org/grpc v1.25.1

It'll work well.

I believe #11564 should be backported to v3.3 ASAP, because it doesn't compile with stable grpc.

Meanwhile, you can do replace google.golang.org/grpc => google.golang.org/grpc v1.26.0 in your go.mod to force use v1.26, which is compatible with etcd <= v3.3.19
